Building eval sets

An eval set is a versioned collection of test cases that you run against your agent to measure quality, detect regressions, and build confidence before deploying changes. This page covers how to build one from scratch, how to grow it, and how to structure individual cases.

Start small and hand-pick

Resist the urge to generate hundreds of cases automatically from the start. Begin with 5-10 cases that you write by hand. Each case should:

  • Represent a task your agent is actually expected to do.
  • Have a clear, unambiguous correct behavior that a human can verify.
  • Come from a real or realistic user input — not a contrived edge case.

Hand-picked cases are valuable precisely because you thought carefully about what correct behavior means. Auto-generated cases often cluster around the same distribution and miss the nuance of real usage.

Once you have 5-10 golden cases, you have something to run. Run them. Fix failures. Then expand.

Growing the dataset over time

Expand in three directions:

Coverage cases — Tasks your agent should handle that are not yet represented. Walk through your agent's intended use cases systematically and identify gaps. Add at least one case per distinct task type.

Regression cases — Every time a real bug or failure surfaces (in testing or production), write a case that would have caught it. Add it before you fix the bug so you can verify the fix.

Adversarial cases — Inputs designed to probe failure modes: ambiguous requests, conflicting instructions, missing required information, tool outputs that contain unexpected formats, inputs that try to override the agent's behavior. See Red-team workflows for a structured approach to this category.

Hold out a test set

Split your eval data into a development set and a held-out test set. The development set is used during iteration — you look at failures and tune. The test set is run only when you are considering a significant change (new model version, major prompt revision, new tools). If you evaluate against the test set too frequently, you will unconsciously overfit to it.

A reasonable split is 80% dev / 20% test, with at minimum 5 cases in the test set.

Version your eval data

Your eval set is code. Put it in version control alongside your agent. Tag releases so you can compare eval-set v1.2 results on agent v3.0 with the same eval set on a later agent version. Never mutate cases in place — append new versions of a case and mark the old one deprecated.

Recommended naming convention for JSONL files:

Eval case schema

Each eval case should have at minimum the following fields:

description string One sentence explaining what this case tests
input object The exact input passed to the agent (user message, context, etc.)
expected_tools list of strings Tool names that must be called, in order if order matters
expected_output_pattern string Regex or natural-language description of what the output must contain
must_not_do list of strings Behaviors that would constitute a failure regardless of output content
rubric_ref string Reference to the rubric used to score this case
tags list of strings Category labels, e.g. ["core", "adversarial", "safety"]

The must_not_do field is important and often omitted. It makes safety constraints explicit at the case level. Examples: "call the delete_record tool", "include patient names in output", "loop more than 5 times".

Labeling rubric per case

For each case, define how a human reviewer would score it if automated checks are inconclusive. Keep the rubric tight:

  • Pass: All expected_tools called in the right order, output matches expected_output_pattern, no must_not_do violations.
  • Partial: Output is acceptable but tool usage was suboptimal (e.g., called an extra unnecessary tool).
  • Fail: Any must_not_do violation, wrong tool called, output does not match pattern.

Keeping evals honest

A few practices that prevent eval sets from becoming theater:

  • Do not show the eval cases to the model during fine-tuning or few-shot prompting.
  • Do not adjust the expected behavior in a case to match current model output unless the old expected behavior was genuinely wrong.
  • When a new model version passes more cases than the old one, review the diffs manually — a model can "pass" a case by producing output that technically matches the pattern but is subtly incorrect.
